1: Training Llama 3.1 405B

  • Massive Training Effort: We trained Llama 3.1 405B on over 15 trillion tokens using more than 16,000 H100 GPUs, making it our largest model ever.

2: Optimized Training Process:

  • Meta significantly improved our training stack to handle the large scale.
  • Meta used a standard decoder-only transformer model with minor tweaks to keep training stable.

3: Iterative Post-Training:

  • Each round of training involved supervised fine-tuning and direct preference optimization.
  • This helped us create high-quality synthetic data and improve model performance.

4: Enhanced Data Quality:

  • Meta improved the quality and quantity of data for both pre- and post-training.
  • This involved better pre-processing, curation, quality assurance, and filtering techniques.

5: Model Performance:

  • As expected, Llama 3.1 405B outperforms smaller models trained in the same way.
  • The 405B model also helps improve the post-training quality of our smaller models.

6: Efficient Inference:

  • Meta reduced compute requirements by quantizing our models from 16-bit (BF16) to 8-bit (FP8).

Instruction and Chat Fine-Tuning

Goal: With Llama 3.1 405B, our aim was to make the model more helpful, detailed, and safe when responding to user instructions.

2: Post-Training Process:

  • We improve the model through several rounds of alignment after initial training.
  • Each round includes: Supervised Fine-Tuning (SFT), Rejection Sampling (RS), Direct Preference Optimization (DPO)

3: Synthetic Data Generation:

  • Llama 3.1 generate most of our SFT examples using synthetic data.
  • Multiple iterations help us produce higher quality synthetic data for all capabilities.
  • We use various data processing techniques to filter and improve this data.

4: Balancing Quality:

  • Meta ensure the model maintains high quality across all capabilities.
  • Meta keep the quality high on short-context benchmarks, even with a 128K context.
  • The model remains helpful while adding safety measures.

The Llama System

Vision: Llama models are part of a bigger system designed to work with various components, including external tools. Our goal is to provide developers with a flexible system to create custom solutions that fit their needs. This idea started last year when we began integrating components beyond the core language model.

1: New Components:

  • Llama Guard 3: A multilingual safety model.
  • Prompt Guard: A filter to prevent prompt injection.
  • Sample Applications: These are open source and can be built upon by the community.

2: Collaboration and Standards:

  • The current implementation of Llama System components is fragmented.
  • Llama is working with industry, startups, and the community to better define the interfaces of these components.
  • Llama is are releasing a request for comment on GitHub for "Llama Stack," a set of standardized interfaces for building components like fine-tuning and synthetic data generation.
